What problem does this paper solve?
Knowledge access and provenance. A model that has memorised a fact cannot cite it, cannot be corrected without retraining, and cannot be audited.
What mathematical objects are introduced?
The latent-variable factorisation
in two variants — RAG-Sequence, marginalising once per output sequence, and RAG-Token, marginalising at each token. These are different models, not two implementations of one.
What assumptions are made?
That top- truncation of the sum is adequate, and that the document encoder can be held fixed while the query encoder is trained (so the index need not be rebuilt during training). The second is an engineering compromise with a real cost: the document representations are never adapted to the task.
What equations matter?
The two marginalisations, and the gradient through , which is what makes the training end-to-end: the query encoder receives a signal telling it to up-weight documents that improved the generation likelihood — an empirical approximation to the true posterior that the variational bound identifies as the right target.
What theorem or result is important?
No theorem. State-of-the-art on open-domain question answering at the time, with the additional property that the retrieved passages provide attribution and that swapping the index changes the model's knowledge without retraining.
What proof techniques are used?
None.
What prior mathematics is required?
Marginalisation and latent-variable models; the difference between a mixture of products and a product of mixtures; dense retrieval geometry.
Limitations
Only – documents fit in context, so the marginalisation is a severe truncation; the document encoder is frozen; the retrieval distribution over a truncated support is not the true posterior; and the whole system inherits the recall ceiling — the generator cannot use a document the retriever did not return.
Why it mattered
It is the origin of the term and of the architecture, and it framed retrieval augmentation probabilistically rather than as a prompt-engineering trick. Almost every subsequent RAG variant is an intervention on one of the two factors in its central equation.
